It's like how a lot of anime is inherently cringe, but you don't notice it unless you're listening to a dub. If you don't know Japanese, the language acts as a cringe-shield.

This really doesn't change if you learn Japanese. It's more like Japanese media in general has super over the top acting/voices and anime takes that just another step further.
